Greetings, brave adventurer! You have forged models that see patterns in numbers. Now you enter the Hall of Tongues, where machines learn to read, write, and converse. This quest, Natural Language Processing, takes you from raw text - the messiest data of all - to the transformer architecture that powers every modern large language model. By its end you will have run a real pretrained model on your own words and understood the attention mechanism that made it possible.
Whether you have only chatted with an AI assistant or you already wonder what "tokens" really are, this adventure demystifies the technology that has reshaped computing.
๐ The Legend Behind This Quest¶
For decades, machines struggled with language. Early systems counted words; later ones read text one token at a time with recurrent networks that forgot the beginning of a sentence by the time they reached its end. Then, in 2017, a paper titled "Attention Is All You Need" introduced the transformer, which reads an entire sequence at once and learns which words should attend to which others. This single idea - self-attention - unlocked GPT, BERT, Claude, and the entire era of large language models.
This quest teaches you the pipeline every NLP practitioner uses: turn text into tokens, tokens into vectors, vectors into meaning, and meaning into predictions.
๐ฏ Quest Objectives¶
By the time you complete this journey, you will have mastered:

๐งโโ๏ธ Chapter 1: Tokenization - Cutting Language Into Pieces¶
A model cannot read letters. It reads integers. Tokenization is the bridge: it splits text into subword tokens (pieces like token, ##ization) and maps each to an id. Modern tokenizers learn these pieces from data so that even unseen words decompose into known fragments.
โ๏ธ Skills You'll Forge in This Chapter¶
- Splitting text into subword tokens and ids
- Understanding why subwords beat whole words
- Reading the special tokens models expect
๐๏ธ Tokenizing Real Text¶
from transformers import AutoTokenizer
# DistilBERT is small and fast - ideal for learning
tok = AutoTokenizer.from_pretrained("distilbert-base-uncased")
text = "Transformers revolutionized natural language processing."
enc = tok(text)
print("Token ids:", enc["input_ids"])
print("Tokens: ", tok.convert_ids_to_tokens(enc["input_ids"]))
# Note the [CLS] start token and [SEP] end token the model expects,
# and how rare words split into subword pieces.
Subword tokenization is why a model never truly hits an "unknown word": it falls back to smaller pieces. A token is roughly 3-4 characters of English on average, which is why API pricing and context limits are measured in tokens, not words.
๐ Knowledge Check: Tokenization¶
- Why do models use subword tokens instead of whole words?
- What do the
[CLS]and[SEP]tokens mark? - Roughly how many characters is one English token?
โก Quick Wins and Checkpoints¶
- Environment ready:
import transformersworks - First tokenization: You printed token ids for your own sentence
๐งโโ๏ธ Chapter 2: Embeddings - Meaning as Geometry¶
Once text is tokenized, each token becomes a high-dimensional vector called an embedding. The magic: vectors for words with similar meaning sit close together. "King" minus "man" plus "woman" lands near "queen". Meaning becomes geometry you can measure.
โ๏ธ Skills You'll Forge in This Chapter¶
- Turning sentences into vectors
- Measuring similarity with cosine distance
- Seeing why embeddings power search and clustering
๐๏ธ Sentence Similarity From Embeddings¶
import numpy as np
import torch
from transformers import AutoTokenizer, AutoModel
name = "distilbert-base-uncased"
tok = AutoTokenizer.from_pretrained(name)
model = AutoModel.from_pretrained(name)
def embed(sentence):
enc = tok(sentence, return_tensors="pt")
with torch.no_grad():
out = model(**enc)
# Mean-pool the token vectors into one sentence vector
return out.last_hidden_state.mean(dim=1).squeeze().numpy()
def cosine(a, b):
return np.dot(a, b) / (np.linalg.norm(a) * np.linalg.norm(b))
a = embed("The cat sat on the mat.")
b = embed("A feline rested on the rug.")
c = embed("Quarterly revenue exceeded forecasts.")
print("similar pair:", round(cosine(a, b), 3)) # high
print("unrelated: ", round(cosine(a, c), 3)) # low
The two sentences about a cat score high similarity despite sharing almost no words, because the meaning is close. This is the engine behind semantic search, recommendation, and retrieval-augmented generation (RAG).
๐ Knowledge Check: Embeddings¶
- What does a high cosine similarity between two sentence vectors mean?
- Why can two sentences with no shared words still be "similar"?
- Name one application built directly on embedding similarity.
๐งโโ๏ธ Chapter 3: Attention, Transformers, and LLMs¶
The transformer's core is self-attention: for every token, the model computes how much it should "pay attention" to every other token, then mixes their information accordingly. This lets the word "it" in a sentence look back and bind to the noun it refers to, no matter how far away.
โ๏ธ Skills You'll Forge in This Chapter¶
- Explaining self-attention in plain language
- Distinguishing pretraining, fine-tuning, and prompting
- Running a full pretrained model with one line
๐๏ธ Attention in One Picture¶
Self-attention scores every pair of tokens. Conceptually, each token emits a query, every token offers a key, and the dot product of query and key decides how much of each token's value flows into the result:
"The animal didn't cross the street because it was tired."
When processing "it", attention learns to weight "animal" heavily
(it = the animal) rather than "street". The model discovers this
relationship from data - no one hand-codes the rule.
Because every token attends to every other in parallel, transformers train far faster than the old sequential recurrent networks and capture long-range meaning. Large language models are simply very large transformers: pretrained on trillions of tokens to predict the next token, then fine-tuned or prompted for specific tasks. Hallucination arises because the model optimizes for plausible next tokens, not verified truth.
A pretrained pipeline hides all of this behind one call:
from transformers import pipeline
# Sentiment analysis with a model fine-tuned for the task
classifier = pipeline("sentiment-analysis")
print(classifier("This quest finally made transformers click for me!"))
# [{'label': 'POSITIVE', 'score': 0.999...}]
# Named entity recognition: pull people, places, organizations out of text
ner = pipeline("ner", grouped_entities=True)
print(ner("Hugging Face is based in New York and Paris."))
๐ Knowledge Check: Attention & LLMs¶
- In plain words, what does self-attention compute for each token?
- Why do transformers train faster than recurrent networks?
- What is the difference between pretraining and prompting?
๐ฎ Mastery Challenges¶
๐ข Novice Challenge: Tokenize and Count¶
Objective: Compare token counts across sentences.
Requirements: - [ ] Tokenize three sentences of different lengths - [ ] Print the number of tokens for each - [ ] Identify which sentence split a rare word into subwords
Validation: Longer or rarer-word sentences show more tokens, and you can point to a subword split.
๐ก Intermediate Challenge: Build a Semantic Search¶
Objective: Rank a small set of documents by relevance to a query.
Requirements:
- [ ] Embed five short documents and one query with the Chapter 2 embed function
- [ ] Score each document by cosine similarity to the query
- [ ] Print the documents sorted from most to least relevant
Validation: The most topically related document ranks first.
๐ด Advanced Challenge: Compare Two Models¶
Objective: Run a task through two pretrained models and compare.
Requirements: - [ ] Run sentiment analysis on the same five reviews with the default model and one other (e.g. a multilingual model) - [ ] Find one example where the models disagree - [ ] Write two sentences on why they might differ
Validation: You produce a concrete disagreement and a plausible explanation.
